Human-in-the-Loop in Machine Learning: What Is It and How Does It Work?

Machine learning models largely rely on data prepared by humans, but the interaction between humans and machines goes further than that. The most effective systems enable continuous interaction between both through a mechanism known as “Human-in-the-Loop” (HITL).

Although the term might seem misleading—suggesting that machines dominate humans—the reality is the opposite. This explanation aims to clarify the concept of HITL and demonstrate how it can be beneficial.

HITL: A Misleading Term, A Valuable Concept

AI models don’t predict with absolute certainty because their understanding is statistically driven, lacking the absolute certainty humans are accustomed to. To manage this uncertainty, some AI systems allow direct human interaction.

Through this feedback mechanism, machines adjust their “understanding.” It’s akin to teaching a child to correctly identify a cat instead of a dog through repeated correction.

Formally, HITL refers to systems where humans provide direct feedback to a model when its predictions fall below a certain confidence level.

In practice, you need to decide the acceptable confidence level for predictions. A lower threshold means more human intervention is required, whereas a higher threshold demands less manual oversight.

Why Not Just Use Better Algorithms?

Despite significant advancements in AI, there’s a simple principle: More training data = better performance. The challenge is that high-quality training data is scarce and often requires human expertise to create, especially for specific problems.

Rather than spending years compiling a perfect dataset, you can start training a model early, which can already yield productivity benefits.

Human and Machine Collaboration

HITL aims to achieve what neither humans nor machines can accomplish alone. When a machine can’t solve a problem, human intervention is necessary, creating a continuous feedback loop. This ongoing feedback helps the algorithm learn and improve.

HITL can be integrated into two main types of machine learning: supervised and unsupervised learning.

In supervised learning, labeled data sets train algorithms to produce functions that map new examples correctly. In unsupervised learning, algorithms must find structures in unlabeled data on their own, which is where the HITL approach in deep learning comes in.

The Importance of HITL in Machine Learning

Improving Accuracy with Rare Datasets

Conventional machine learning models require vast amounts of labeled data for accuracy. In cases where data is scarce, these models fall short.

For instance, if you’re looking for information in a language spoken by only a few thousand people, the algorithm might lack sufficient examples. HITL can ensure accuracy in such rare datasets.

In healthcare, the debate about automation versus human oversight is ongoing. A 2018 Stanford study found that HITL AI models outperform both standalone AI and human doctors.

These systems can enhance accuracy while maintaining human-level quality, applicable across various industries, revolutionizing global work practices.

Enhancing Safety and Precision

Certain situations require AI to deliver human-level precision for safety and accuracy. In manufacturing critical vehicle or airplane parts, equipment must meet high standards. While machine learning aids inspections, human monitoring remains crucial.
